Learning objectives
- What would your AI release gate measure?
- How would you explain AI uncertainty to an executive?
- Apply Held-out evaluation to a customer decision and defend the tradeoff.
The mental model
An AI release can pass ordinary unit tests while giving worse answers. It can also improve an average score while failing a small but important customer segment. Evaluation therefore needs several layers: deterministic application checks, task quality assessment, security tests, and operational measurements. Keep a baseline and compare changes on the same cases. Human review is useful when quality is subjective, but reviewers need clear criteria and examples. Automated judges can assist assessment without becoming unquestionable authorities. Your experience creating evaluation and developer tools can demonstrate disciplined experimentation, provided you distinguish the harness you built from business outcomes that have not been verified.
How it works
Version the model choice, prompt, retrieval configuration, source corpus, tool definitions, and application code so a result can be traced to a concrete system state. Separate development examples from a held-out set that reveals whether improvements generalize. Measure per-category performance and inspect regressions rather than optimizing one aggregate number. Include abstention quality, citation correctness, unauthorized access attempts, malformed tool arguments, and recovery after provider failures.
Use deterministic fixtures to test API parsing, timeout logic, state transitions, and permissions. Run model evaluations for semantic behavior with enough repeated or varied cases to expose instability. A judge model can introduce bias and correlated errors; calibrate it against human-reviewed samples and do not use its score as proof of correctness. For release decisions, define blocking failures and acceptable tradeoffs in advance. Monitor quality after rollout using privacy-aware samples and an escalation path. A canary or limited pilot should have a rollback condition and a stable comparison baseline. Security controls must be enforced outside the model even when evaluation results appear excellent.
Create a release comparison with rows for factual correctness, source support, appropriate abstention, authorization, tool validity, latency, and cost. Mark some rows as non-negotiable gates and others as tradeoffs requiring review. Inspect examples behind score changes. If a new retrieval configuration improves average relevance but misses a critical operational procedure, the category matters more than the aggregate. Keep the rejected change and evaluation evidence so future experiments do not unknowingly repeat the same failure.
Applied example · hypothetical
Hypothetical scenario: a new prompt improves concise answers but removes important uncertainty language from missing-evidence cases. The overall preference score rises because most test questions have clear answers. A category-level review catches the regression in abstention behavior. The team blocks the change, adds representative missing-source cases, and revises the rubric. A separate fixture verifies that denied tool calls remain denied regardless of generated text. The example shows why the release decision cannot rely on a single quality number.
In a customer engagement
Work with the customer to define a useful answer and an unacceptable failure before the demonstration. Include support, security, and domain experts in reviewing a small shared set of cases. Present regressions candidly and distinguish measured results from expectations. Agree on who reviews uncertain outputs and how feedback becomes a versioned evaluation case.
Interview relevance
In an interview, describe evaluation as a release discipline rather than a benchmark screenshot. Explain one failure category, its test data, its acceptance criterion, and what action follows a regression. If discussing your AI-native tooling, use verified artifacts and outcomes; mark adoption, time savings, and production impact as needing evidence when they are not documented.
Common mistakes
- Relying on one aggregate score
- Treating model judging as infallible
- Promising guaranteed correctness
Key terminology
Held-out evaluation — Assessment using cases not used to tune the current system, helping detect overfitting.
Abstention quality — How appropriately a system declines to answer when evidence or authority is insufficient.
Evaluation regression — A deterioration in a defined behavior or category after a system change.
