Combine AI services and observability into a defensible architecture

12 min read · Sources linked below

Theory and industry practice are explained below. Cloudflare-specific behavior links to official documentation. Customer examples are hypothetical.

Learning objectives

  • Explain Workers AI, AI Gateway, and Vectorize to a CTO.
  • Which observability signals would you require before expanding an AI pilot?
  • Apply Inference plane to a customer decision and defend the tradeoff.

The mental model

An AI application needs more than a model endpoint. Workers AI supplies model inference, AI Gateway adds a management and observation layer around supported inference traffic, and Vectorize stores and searches vector representations. Workers can coordinate application requests while other data services hold documents and records. Analytics and observability reveal what the system actually does, but a dashboard is only useful when its measurements answer a decision. Keep model quality, retrieval quality, application availability, and cost as separate dimensions. A successful HTTP response can contain an incorrect answer, and a lower model bill can conceal a worse customer experience.

How it works

A retrieval application usually has ingestion and query paths. Ingestion extracts and chunks approved documents, creates embeddings with a chosen model, and stores searchable vectors with document metadata. Query handling authenticates the user, retrieves authorized material, constructs bounded context, and invokes inference. Vectorize is a search component, not an authorization engine or a source of guaranteed truth. Workers AI and AI Gateway solve different problems: the former executes available models, while the latter offers controls and visibility around supported provider traffic.

Instrument the application with a request identifier spanning retrieval, inference, and response construction. Observe latency distributions, provider errors, tokens or model-specific consumption, cache behavior, and quality evaluations. Workers observability can support application diagnosis, but available datasets, retention, sampling, and plan entitlements must be checked. Do not log confidential prompts by default. A customer architecture should identify which metrics are collected, their sensitivity, and who can access them. Compare a simple hosted-model integration against a multi-service design; additional components are justified only when their operational benefit exceeds their complexity.

For a useful trace, record retrieval duration, number of authorized passages selected, model identifier, inference duration, and a safe quality-review reference. Do not assume lower latency means better retrieval: a failed lookup can return very quickly. Compare a successful answer with an abstention and a provider failure. These three paths should produce distinct user behavior and diagnostic signals, allowing the customer to identify whether an issue belongs to documents, application logic, or inference.

Applied example · hypothetical

Hypothetical scenario: a support team wants answers grounded in its internal runbooks. You propose a small authorized document corpus, a retrieval index, a Worker API, and an inference path observable through AI Gateway. The pilot contains known-answer questions, missing-answer questions, and attempts to cross tenant boundaries. A dashboard reports retrieval misses separately from inference errors. Workers AI is one evaluated execution option, not a promise that every desired model is available. Resolution time and answer quality are proposed outcomes that require measured validation.

In a customer engagement

Ask the customer whether its primary problem is model availability, inconsistent answers, unobservable spend, or unsafe access to documents. Each answer changes the design. Demonstrate one trace that connects a user's request to its retrieved sources and model call. Agree on quality and privacy gates before discussing scale or broader product adoption.

Interview relevance

When asked to explain this stack, distinguish orchestration, inference, retrieval, and control-plane visibility. Use your agent tooling experience to discuss measurement and failure handling, while explicitly labeling any Cloudflare deployment you have not personally operated as a proposed architecture. Include a simpler alternative and a reason you would choose it under tighter constraints.

Common mistakes

  • Calling a vector index a truth engine
  • Assuming all models are supported
  • Logging all prompts without review

Key terminology

Inference plane — The portion of an AI system that executes a model on input and returns output.

Retrieval grounding — Supplying relevant source material to inform an answer without guaranteeing its correctness.

Quality telemetry — Measurements of answer usefulness or correctness, distinct from infrastructure success and latency.
